Is it advisable for a graduate student to learn from a paper published on arXiv?
or that it is better to stick to peer-reviewed works since fresh graduate students do not yet have much experience with the field.

Peer reviewed journals sometimes take years to publish a paper so something archived on arXiv might be more up-to-date. Quite obviously these papers have not undergone a strict peer review process, so some caution might be needed.
