It is commonly stated that the earth is a storehouse of electrons/ A search in the internet didn't provide a reason. Can you help? What about the stars? Is it related to the atomic constitution? But then all atoms have equal number of protons and electrons

This is like stating that 'Mars is a storehouse of electrons'.
It is true, Mars is made of atoms, and atoms are host to electrons.
But I am unsure as to what useful knowledge this leads to.

'By whom': Well, I don't really know! I definitely remember having been taught this during my secondary school days I think, in relation to electricity and earthing, that is all. May be I was also influenced by lessons on lightning, where, as I remember it, -ve charges collect on the ground. And assumed that it is so.
If you say that earth is NOT a storehouse of electrons, I will take your word for it.
May be I should rephrase it as the 'Ground is a storehouse of electrons"?

PS: Now a days when I look up this in the net, what I get is that the earth is a store house and the mystic benefits of connecting our body to the earth which removes negative charges from us or something like that. Even I find this hard to believe this. I am not getting any site on Physics which says anything about this.

I appreciate your scepticism and honesty. Perhaps the source of the half-remembered phrase was alluding to the fact that the Earth, like any somewhat conductive object, allows for the relatively free *movement* of electrons.
So in an electrical circuit, the 'ground' is indeed at some point a large spike in the earth close to the power station - and so a fault at the far end of the circuit, allowing electricity to touch the 'ground' (sometimes via a human) will indeed allow current to flow back to the power station.
But in no way is the Earth a *source* of electrons - whilst one can create and make them, it's not trivial to do so and the Earth does not engage in such goings on.
Earth's surface is somewhat negatively charged so it does contain an excess of electrons. This is related to the phenomenon of lightening. Overall the earth is neutral with an excess of positive charge in the atmosphere. Regarding electric circuits the potential of the earth can be regarded as zero and current reaching it will indeed close the circuit back to the power station because of the relatively high conductivity as stated in the previous reply.
